The paper investigates a specific challenge causing hallucinations in large language models (LLMs), spurious correlations. These are misleading but statistically strong associations in the training data that cause LLMs to generate confidently incorrect outputs. The study finds that these hallucinations persist despite efforts like model scaling, confidence filtering, and refusal fine-tuning. Using synthetic experiments and evaluations on leading models including GPT-5, it shows that existing detection methods fail against hallucinations caused by strong spurious correlations. The work provides a theoretical explanation for why LLMs rely on these biases during generalization, making hallucinations hard to detect and undermining reliability. It stresses the urgent need for new techniques explicitly designed to address hallucinations from spurious correlations, to improve the trustworthiness and robustness of AI-generated content.
